BigGANで実験してみた!!【図解速習DeepLearning】#011

こんにちは!こーたろーです。

昨日の投稿では、【図解速習DEEP LEARNING】のGANで、高精細画像生成に取り組みました。

BigGANでは、本物の画像と偽物の画像を識別する「識別機:Discriminator」と与えられたデータから、学習データの分布を学習し、リアルな画像を生成する「生成器:Generator」から成ります。

今回は、BigGANでちょっとした実験を行っていきたいと思います。

1.必要なライブラリーのインポート

from IPython import display
import numpy as np
from scipy.stats import truncnorm
import tensorflow as tf
import tensorflow_hub as hub
import matplotlib.pyplot as plt

tf.compat.v1.disable_eager_execution()

2.TF_HubからGigGANのモデルを取得

今回は、「3)BigGAN-512」を使用してみます。

tf.compat.v1.reset_default_graph()
model_size = "3)biggan-512" #@param ["1)biggan-128" , "2)biggan-256" , "3)biggan-512"]
which_model = model_size.split(')')[1]
module_path = 'https://tfhub.dev/deepmind/'+which_model+'/2'
module = hub.Module(module_path)

f:id:dsf-kotaro:20210206172530p:plain

モデルの入出力を確認していきます。

inputs = {k: tf.compat.v1.placeholder(v.dtype, v.get_shape().as_list(), k)
          for k, v in module.get_input_info_dict().items()}
output = module(inputs)

print ('Inputs:\n', '\n'.join(
        '{}: {}'.format(*kv) for kv in inputs.items()))

print ('Output:', output)

f:id:dsf-kotaro:20210206172617p:plain

サンプリングするレベルの数と潜在空間のサイズzと変数定義していきます。
潜在空間について、述べていませんでしたが、この「潜在空間」とは、学習させた画像の特徴量の分布のことです。
この特徴量を意図的に変化させることによって、思った通りに変化させた画像を生成させることができます。

vocab_size = inputs['y'].get_shape().as_list()[1]
latent_size = inputs['z'].get_shape().as_list()[1]

print('Number of labels ', vocab_size)
print('The size of the latent space ', latent_size)

f:id:dsf-kotaro:20210206172713p:plain

このモデルにおいては、ラベル入力を1つのワンホットベクトルとして受け取ります。対応するクラス以外はすべて0の行列ベクトルとしてマッピングしていきます。

ワンホットベクトルを作成していきます。

def one_hot(index, vocab_size=1000):
  index = np.asarray(index)
  if len(index.shape) == 0:
    index = np.asarray([index])
  assert len(index.shape) == 1
  num = index.shape[0]
  output = np.zeros((num, vocab_size), dtype=np.float32)
  output[np.arange(num), index] = 1
  return output

ワンホットエンコーディングの関数を定義します。

def get_zy(index, trunc = 1., batch_size = 1, seed = None):
  y = one_hot(index)
  z = truncnorm.rvs(-2, 2, size=(batch_size, latent_size), random_state = np.random.RandomState(seed)) * trunc
  return z, y
z, _ = get_zy(np.random.choice(range(0, vocab_size), size = 1),  seed = 2)

y = np.linspace(0, latent_size, latent_size)

plt.scatter(y, z)
plt.show()

f:id:dsf-kotaro:20210206172821p:plain

3.モデルのテスト

inputのセッションとともに、グラフを動作させていきます。

def generate(sess, z, y, trunc = 1.):
  feed_dict = {inputs['z']: z, inputs['y']:y, inputs['truncation']: trunc}
  im = sess.run(output, feed_dict=feed_dict)

  im = np.clip(((im + 1) / 2.0) * 256, 0, 255)
  im = np.uint8(im)
  im = im.squeeze()
  return im

f:id:dsf-kotaro:20210206172925p:plain

f:id:dsf-kotaro:20210206173003p:plain

セッションを作成し、画像を生成・表示

with tf.compat.v1.Session() as sess:

  trunc = 0.02

  sess.run(tf.compat.v1.global_variables_initializer())

切り捨て値【truncation】については、今度解説したいと思いますが、この切り捨て値を大きくすると、サンプリングされた画像のばらつきが大きくなります。

with tf.compat.v1.Session() as sess:
  images = None
  sess.run(tf.compat.v1.global_variables_initializer())

  index = 156

  for trunc in np.linspace(0.04, 1. , 5):
    images = None

    print('truncation value ', np.round(trunc, decimals = 2))
    for i in range(0, 2):
      z, y = get_zy(index, trunc = trunc)

      im = generate(sess, z, y, trunc = trunc)

      if images is None:
        images = im
      else:
        images = np.concatenate([images, im], axis = 1)
    plt.axis('off')
    plt.imshow(images)
    plt.show()

4.潜在空間の補完

2つのzベクトルをそれぞれv1、v2として、この二つのベクトルに関数で補間(移動)を掛けていく

4.1線形補間

def interpolate_linear(v1, v2, num_steps):
  vectors = []
  for x in np.linspace(0.0, 1.0, num_steps):
    vectors.append(v2*x+v1*(1-x))
  return np.array(vectors)

4.2超球面補間

def interpolate_hypersphere(v1, v2, num_steps):

  v1_norm = LA.norm(v1)
  v2_norm = LA.norm(v2)
  v2_normalized = v2 * (v1_norm / v2_norm)

  vectors = []
  for step in range(num_steps):
    interpolated = v1 + (v2_normalized - v1) * step / (num_steps - 1)
    interpolated_norm =  LA.norm(interpolated)
    interpolated_normalized = interpolated * (v1_norm / interpolated_norm)
    vectors.append(interpolated_normalized)
  return np.array(vectors)

5.GIFアニメーションで補間を確認

線形変換での補完を確認してみます。
もしも、超球面補間をやる場合は、「interpolate_linear」を「 interpolate_hypersphere()」に置き換えてみてください。

with tf.compat.v1.Session() as sess:
  num_interps = 10

  sess.run(tf.compat.v1.global_variables_initializer())
  images = []

  trunc = 0.4
  k = 91
  l = 98

  v1, y1 = get_zy(0, trunc = trunc, seed = k)
  v2, y2 = get_zy(0, trunc = trunc, seed = l)

  interps_z = interpolate_linear(v1 , v2, num_interps)
  interps_y = interpolate_linear(y1,  y2, num_interps)

  for i in range(0, num_interps):
    z = interps_z[i]
    y = interps_y[i]

    im = generate(sess, z, y, trunc = trunc)
    images.append(im.squeeze())

GIFアニメーション表示用のライブラリーをインポートします。

!pip install imageio
import imageio

f:id:dsf-kotaro:20210206175134p:plain

GiFアニメーションを表示させます。

def create_animation(images):
  imageio.mimsave('./animation.gif', images)
  with open('./animation.gif','rb') as f:
      display.display(display.Image(data=f.read(), height=512))
create_animation(images)

【実験1】前景を保ちながら、任意の画像の背景を変更する

やり方としては、前景画像を安定させるためにsin(z)を使っていきます。
sin(x)だと、ゼロに近い値を保持しながら、ゼロではない値に変更できるため、背景が変更できます。

with tf.compat.v1.Session() as sess:
  images = None
  sess.run(tf.compat.v1.global_variables_initializer())

  trunc = 1.0

  index = 0

  z, y = get_zy(index, trunc = trunc)
  im1 = generate(sess, z, y, trunc = trunc)
  im2 = generate(sess, np.sin(z), y, trunc = trunc)

  images = np.concatenate([im1, im2], axis = 1)
  #show the image
  plt.axis('off')
  plt.imshow(images)
  plt.show()

左側が変更前、右側が変更後です。
メインの魚のところの状態を殆ど変化させずに、背景を中心に変更できているのが分かります。

f:id:dsf-kotaro:20210207223748p:plain

【実験2】生成された画像の詳細確認

特定のカテゴリを詳しく確認します。

【Seed=2】の場合

with tf.compat.v1.Session() as sess:
  images = None
  sess.run(tf.compat.v1.global_variables_initializer())

  trunc = 1.0

  index = 0

  z, y = get_zy(index, seed = 2)

  im1 = generate(sess, -0.5*(z/np.abs(z)), y)
  im2 = generate(sess, -1.0*(z/np.abs(z)), y)
  im3 = generate(sess, -1.5*(z/np.abs(z)), y)

  images = np.concatenate([im1, im2, im3], axis = 1)
  plt.axis('off')
  plt.imshow(images)
  plt.show()

f:id:dsf-kotaro:20210207223918p:plain

【Seed=8】の場合

with tf.compat.v1.Session() as sess:
  images = None
  sess.run(tf.compat.v1.global_variables_initializer())

  trunc = 1.0

  index = 0

  z, y = get_zy(index, seed = 8)

  im1 = generate(sess, -1.0*(z/np.abs(z)), y)
  im2 = generate(sess, -1.5*(z/np.abs(z)), y)

  images = np.concatenate([im2, im1], axis = 1)
  plt.axis('off')
  plt.imshow(images)
  plt.show()

f:id:dsf-kotaro:20210207223945p:plain

こちらのSEEDは、このプログラムで用いられるオプション用のランダム変数(整数)です。
今回、潜在ベクトルの領域の切り捨てを行っているのですが、その閾値を設定するための変数設定です。
つまり、Seedを変更すると、潜在ベクトルの表現力が変化することになります。
Seed=2とSeed=8では、表現力がことなっていることが分かります。

参考図書のサンプルソース内でも記述がありますが、切り捨ての閾値をもって切り捨てを行った場合、ベクトルサンプリングの全体的な種類が減少するため、品質と多様性はトレードオフ関係にあることになります。

【実験3】二つの異なるクラス間を行き来してみる

こちらは、エンコードされたベクトルを平均して同じシードベクトルを使用するという単純な演算を行います。

with tf.compat.v1.Session() as sess:
  images = None
  sess.run(tf.compat.v1.global_variables_initializer())

  trunc = 1.0

  i1 = 0
  i2 = 1

  a = 0.5

  z, y1 = get_zy(i1)
  z, y2 = get_zy(i2)

  im1 = generate(sess, z, y1)
  im2 = generate(sess, z, y2)
  im3 = generate(sess, z, a*y1+(1-a)*y2)

  images = np.concatenate([im1, im2, im3], axis = 1)

  plt.axis('off')
  plt.imshow(images)
  plt.show()
